Unsupervised Learning
Unsupervised learning finds structure under a chosen representation and objective. Begin by defining what “similar” should mean for the reader's task, then choose features, scaling, distance, and evaluation accordingly. An algorithm can discover a clean partition of the supplied geometry without discovering meaningful categories in the world.
Use clustering and dimensionality reduction as tools for exploration or a defined downstream process. Keep the interpretation separate from the mathematical output. A colorful projection and a high internal score are useful observations, not automatic evidence of natural groups or causal explanation.
TL;DR
- Define the representation and similarity assumptions before choosing an algorithm.
- Test feature scaling and preprocessing as part of the model.
- Compare stability and relevant external usefulness alongside internal metrics.
- Treat low-dimensional projections as incomplete views of the data.
- Keep cluster labels separate from semantic or consequential classifications.
Quick Example
This scikit-learn example uses four fictional points. Rescaling the second feature changes the KMeans partition, and PCA returns a one-dimensional projection.
The assertion checks that the two partitions differ up to label permutation. That says nothing about which partition, if either, is correct. There are no ground-truth semantic labels in this example, and the projection's shape does not establish preservation of every relationship useful to a downstream task.
Core Concepts
Scikit-learn's clustering guidance describes different cluster assumptions and internal evaluation such as silhouette. The silhouette coefficient evaluates separation under the supplied distances and tends to favor certain cluster shapes; it is not a semantic correctness score. Clustering guidance.
Its PCA documentation describes orthogonal components that explain variance. The implementation centers features but does not automatically scale their units before decomposition. Maximum retained variance is a specific objective rather than a guarantee of preserving task-relevant information. PCA guidance.
Separate representation, objective, optimization result, and interpretation. Each introduces assumptions. Naming the final clusters does not remove the choices made earlier in the pipeline.
Choose the question before the method
This editorial investigation map does not prescribe a universal algorithm or rank models across unrelated tasks.
For a fictional catalog of machines, similarity might mean operating behavior, physical characteristics, or maintenance needs. Combining all available numeric fields without defining that purpose can make the largest-scale variable dominate the result.
Make geometry a reviewed modeling choice
Document feature meanings, units, transformations, missing-value handling, and distance. Scaling is not a cosmetic normalization step; it changes which differences count as large. The example intentionally demonstrates that dependency.
Avoid blindly treating identifiers or encoded categories as meaningful coordinates. A numeric product ID can impose an arbitrary ordering and distance that has no relationship to the intended task. Use a representation justified by the domain and method.
Fit learned preprocessing within the appropriate training/evaluation arrangement when the result feeds a downstream model. Unsupervised transformations can still leak information if fitted on data that should remain unavailable during evaluation.
Inspect outliers and sampling. A method may allocate capacity to unusual observations, absorb them into broad groups, or label them as noise depending on its objective. Decide whether that behavior is useful before interpreting the partition.
Evaluate stability without confusing it with truth
Compare results across justified preprocessing choices, random initializations, samples, and time windows. Large changes can reveal an unstable conclusion or a changing population. Small changes are useful evidence of stability under those variations, not proof of natural categories.
Use metrics that respect label permutation when comparing partitions. Cluster number zero in one run need not correspond to zero in another. A direct equality check on label arrays can report disagreement even when the partition is identical.
Internal measures answer questions about the model's geometry. External labels, when available and suitable, answer a different question about correspondence to a known classification. Downstream performance tests ask whether the representation supports the actual use. Report which question each metric addresses.
Keep counts and minority or unusual cases visible. A stable large cluster can coexist with a poorly represented small group. Do not let an overall measure hide the observations most important to the intended task.
Treat projections as lossy representations
A projection can reveal patterns while discarding dimensions. Two points close in a plot may differ along omitted features, and separated visual islands may depend strongly on method settings. Inspect the original representation before drawing consequential conclusions.
For PCA, retained variance is useful context, but a low-variance direction can still matter to a specific prediction or operational rule. Test the downstream requirement rather than choosing dimensions from a universal retained-variance percentage.
Keep the mapping and version available when new data must be transformed. A visualization produced from the entire current dataset may not behave like a stable production representation for future observations. Define whether the method supports the intended out-of-sample use.
Do not attach causal language to a projection simply because one axis correlates with an outcome. The algorithm organized a representation under its objective; intervention claims need a different design and evidence.
Best Practices
Maintain a short modeling record with purpose, features, units, preprocessing, method, parameters, randomization, and evaluation. Include plausible alternatives and the observation that would change the interpretation.
Use domain review to assign meaning cautiously. A cluster can be a useful working segment without being a natural or permanent class. Preserve uncertainty in names and in any downstream action based on the group.
For systems affecting people or consequential access, obtain appropriate domain, privacy, fairness, and legal review. Unlabeled data does not make a decision low impact or remove the need to evaluate consequences. This article's points are fictional and non-personal.
Common Mistakes
Bad: Call clusters real categories because the visualization looks clean.
Correct: State the representation and objective, then evaluate stability, domain meaning, and downstream usefulness separately.
Bad: Compare label numbers directly across runs.
Correct: Use a comparison that accounts for arbitrary label permutation and the question being evaluated.
Bad: Treat feature scaling as irrelevant housekeeping.
Correct: Review the induced geometry and test whether the choice matches the intended notion of similarity.
FAQ
Does no target label mean no evaluation is possible?
No. Internal geometry, stability, reconstruction, and downstream usefulness can be evaluated. Their limits must remain explicit because they answer different questions.
Does PCA automatically standardize features?
The cited implementation centers but does not automatically scale feature units. Choose and record any additional preprocessing deliberately.
What would reverse a clustering recommendation?
Unstable partitions, inappropriate distance, poor downstream usefulness, or unacceptable consequences can change the choice. A higher internal score alone should not override those failures.
